    This line could simply mean that Milky Chance was attracted to a woman's beauty and grace, her physical features and the way she carried herself.

    "Into depths of oblivion and to the lover's place"
    The lover's place referred to here could mean intimacy, physical contact or even sex. The depths of oblivion, refer to how he blindly fell in love with the woman he saw by the river.
